If you’ve ever tried to ask a question across tens of thousands of knowledge base articles and gotten back a confidently wrong answer from a vanilla RAG pipeline, you know the pain I am describing. Earlier this year I was brought in to solve exactly that problem for a Fortune-500 enterprise whose Salesforce-hosted knowledge base had grown into a tangled mess of duplicated, outdated, and contradictory content spread across multiple languages and product lines. Traditional vector-search RAG could find relevant chunks, but it could not reason across articles, detect contradictions, or tell you which piece of information was actually authoritative.
This post is the practitioner’s guide I wish I had when I started. I will walk through the architecture I designed, the tools I chose and why, the problems I ran into, and the concrete outcomes we delivered.
What Is GraphRAG and Why Does It Matter?
GraphRAG (Graph-based Retrieval-Augmented Generation) is an approach to building AI-powered question-answering systems that combines the structural reasoning capabilities of knowledge graphs with the generative power of large language models. Instead of relying solely on vector similarity to find relevant text chunks, GraphRAG first organizes information into a graph of entities and relationships, then traverses that graph to retrieve contextually connected information before passing it to an LLM for answer generation.
In plain terms: traditional RAG says “here are the five most similar text chunks to your question.” GraphRAG says “here is the entity you are asking about, here are the other entities it connects to, here is the chain of reasoning that links your question to an authoritative answer, and here is where the knowledge base contradicts itself.”
The difference matters most when your corpus is large, interconnected, and messy, which describes every enterprise knowledge base I’ve ever encountered.
The Problem: A Knowledge Base That Outgrew Itself
The client had accumulated over 30,000 Salesforce knowledge articles across a decade of operations. These articles covered dozens of product lines in multiple languages. The problems were systemic:
- Massive duplication: the same procedure documented in five slightly different ways across different product versions
- Contradictory guidance: article A says to do X, article B says to do the opposite, neither references the other
- Missing translations: critical articles existed only in one language, leaving entire regions without coverage
- No quality signal: there was no automated way to know which articles were stale, incomplete, or inaccurate
- Shallow search: the existing keyword search could not answer questions that required synthesizing information from multiple articles
A standard RAG pipeline would have embedded the articles and called it a day. But embedding 30,000 articles into a vector store does not solve any of the structural problems above. You just get faster access to the same mess.
Architecture Decisions: Why Neo4j, Why Langflow, Why This Stack
The Knowledge Graph Layer: Neo4j
I evaluated several graph database options and chose Neo4j for three reasons.
First, Neo4j has first-class support for combining graph traversal with vector search in a single query through its vector index feature. This meant I could do hybrid retrieval: start with a vector similarity search to find candidate articles, then expand outward through the graph to pull in related entities, parent-child relationships, and cross-references. No need for a separate vector store.
Second, the Cypher query language is expressive enough to encode complex business rules directly. When the client said “find all articles about product X that contradict each other,” that translates naturally into a graph pattern match.
Third, Neo4j’s visualization ecosystem (particularly its integration with Sigma.js for browser-based interactive exploration) gave stakeholders a way to actually see their knowledge base as a network for the first time. That visual alone justified half the project to the executive sponsors.
The Custom Ontology
Off-the-shelf ontologies didn’t fit. Enterprise knowledge bases have domain-specific structure that generic schemas cannot capture. I designed a custom ontology with the following core node types:
- Article: the knowledge base article itself, with metadata (language, product line, version, quality score)
- Concept: a normalized topic or procedure that one or more articles describe
- Product: a product or service in the client’s catalog
- Symptom/Resolution: for troubleshooting content, the problem-solution pairs extracted from articles
- Regulatory Reference: compliance and regulatory citations that articles depend on
The edges encoded relationships like DESCRIBES, CONTRADICTS, SUPERSEDES, TRANSLATES_TO, and DEPENDS_ON. This structure is what made multi-hop reasoning possible. When a user asked “what is the current procedure for X on product Y in German?”, the system could traverse from the concept node through the product relationship, check for superseding articles, and follow translation edges, all before the LLM saw a single token.
Orchestration: Langflow
For orchestrating the LLM agent workflows, I chose Langflow. The decision was pragmatic. The client’s internal team had limited Python experience but needed to own and modify the system after handover. Langflow’s visual flow builder let me design complex agent chains (query understanding, graph retrieval, answer generation, citation verification) as visual pipelines that the team could inspect, modify, and debug without touching code.
That said, the performance-critical components, specifically the graph construction pipeline, the quality scoring engine, and the batch processing jobs, were all written in Python with direct Neo4j driver calls. Langflow handled the real-time query path; Python handled the offline data processing.
LLM Agent Design
The system used a multi-agent architecture with specialized agents:
- Query Decomposition Agent: breaks complex user questions into sub-queries that map to graph traversal patterns
- Retrieval Agent: executes hybrid vector + graph queries against Neo4j and assembles a context window
- Synthesis Agent: generates the final answer with inline citations and confidence scoring
- Verification Agent: cross-checks the generated answer against the retrieved source articles and flags potential hallucinations
Each agent had a focused prompt, a constrained tool set, and explicit handoff protocols. This separation made the system far more debuggable than a single monolithic agent would have been.
Key Outcomes
Automated Quality Scoring
Every article in the knowledge base received an automated quality score based on completeness (does it cover the expected sections?), freshness (when was it last reviewed?), consistency (does it contradict related articles?), and coverage (are translations available?). This gave the content team a prioritized backlog of articles to fix, something they had been requesting for years.
Multi-Hop Reasoning
The system could answer questions that required chaining information across three or more articles. For example: “What regulatory requirements apply to configuring feature X on product Y for customers in the EU?” required traversing product nodes, feature nodes, regulatory reference nodes, and regional applicability edges. A flat vector search would have returned partial answers at best.
Duplication Detection
By normalizing articles to concept nodes, the system automatically identified clusters of articles describing the same procedure. The content team used this to consolidate duplicates, reducing the effective knowledge base size by a significant percentage and dramatically improving answer consistency.
Translation Gap Analysis
The graph made it trivial to find concepts that had articles in some languages but not others. A single Cypher query produced a complete matrix of content coverage by language and product line, something that had previously required weeks of manual auditing.
When to Use GraphRAG vs Traditional RAG
This is the question I get asked most often, so here is my honest assessment based on implementing both approaches.
Use traditional RAG when:
- Your corpus is relatively small (under a few thousand documents)
- Documents are independent and self-contained (no cross-references matter)
- Questions can be answered from a single document or passage
- You need a fast proof-of-concept with minimal infrastructure
- Your content is well-maintained and low on duplication
Use GraphRAG when:
- Your corpus is large, interconnected, and has complex internal relationships
- Questions require synthesizing information from multiple documents
- You need to detect contradictions, duplications, or gaps in your content
- Provenance and citation accuracy are critical (regulated industries, enterprise support)
- You need to support multi-hop reasoning across entities
- Your knowledge base spans multiple languages, product lines, or versions
The honest tradeoff: GraphRAG requires significantly more upfront investment. You need to design an ontology, build an entity extraction pipeline, stand up a graph database, and tune graph traversal queries. For a quick internal chatbot over a small document set, that is overkill. For a mission-critical enterprise knowledge system where answer quality directly impacts customer outcomes, the investment pays for itself within months.
Lessons Learned
Start with the ontology, not the technology. I spent the first two weeks of this project interviewing subject matter experts and mapping out the conceptual structure of the knowledge base before writing a single line of code. That ontology design phase saved months of rework later.
Hybrid retrieval outperforms pure graph traversal. Using vector similarity as the entry point and then expanding through graph relationships consistently produced better results than starting with pure graph pattern matching. The vector search handles the fuzziness of natural language; the graph handles the structure.
Visualization is not optional. The Sigma.js-powered graph explorer became the single most used internal tool. Content managers, product owners, and support leads all used it daily to understand their content landscape. If you build a knowledge graph and do not provide a visual interface, you are leaving half the value on the table.
Agent separation matters at scale. Early prototypes used a single LLM call for everything. Splitting into specialized agents with clear responsibilities improved answer quality, reduced hallucination rates, and made the system dramatically easier to debug and improve iteratively.
